When I read a dictionary(about「春spring」), there are the sentences "the spring" and "spring (no "the")".
春に土を耕す
turn the earth in the Spring
春に芽を出す草花
plant that put forth buds in the spring
春に種子を蒔くこと
an act of sowing seeds in spring
若芽をつけた春の木
a tree with buds in the spring
春に芽を出し成長する草
grass that grows in the spring
多くの植物は春に花をつける。
Many plants bloom in the spring.
春に木々は新しい葉や芽を出す。
Trees put forth new leaves and buds in spring.

After checking a few opinions of other English speakers online, these are the points I found:
- Generally, it should be fine to use either in most cases
- You must use “the” when referring to a specific summer, eg “In the spring of ‘84”
- British English speakers tend to omit “the”, while American English speakers tend to use it
- With a sentence like “Summers (meaning “every summer), I work at the library”, it would not work to have “The” before it
- This is something that most English speakers aren’t sure about ourselves, and we tend to use “the” or no “the” depending on which set phrase we are using and what area we are from, so it’s just a matter of time and picking up the phrases
So I think there is no big difference in general, but in your example, it seems to be more poetic/romantic to me to leave out “the”
